Symbolic Reasoning (Symbolic AI) and Machine Learning
The four primitive words are direct mappings from one input word to one output symbol (for example, ‘dax’ is RED, ‘wif’ is GREEN, ‘lug’ is BLUE). Function 1 (‘fep’ in Fig. 2) takes the preceding primitive as an argument and repeats its output three times (‘dax fep’ is RED RED RED). Function 2 (‘blicket’) takes both the preceding primitive and following primitive as arguments, producing their outputs in a specific alternating sequence (‘wif blicket dax’ is GREEN RED GREEN).
One disadvantage of ILP is that counter-examples of a relation to be learned need to be provided, in addition to positive examples. It is able to learn individual String-to-String functions and Sequence-to-Sequence functions from small numbers (usually under 10) of examples of the function. It is a very general transformation synthesis tool, which can generate M2M transformations in multiple target languages (QVTr, QVTo, ETL, and ATL). In this paper, we adapt and extend this MTBE approach to learn functions relating software language parse trees, and hence to synthesise T2T code generators. Our work is related to model transformation by-example (MTBE) approaches such as [2, 3], to programming-by-example (PBE) [6, 11], and to program translation work utilising machine learning [4, 12, 16].
Data availability
An epoch of optimization consisted of 100,000 episode presentations based on the human behavioural data. To produce one episode, one human participant was randomly selected from the open-ended task, and their output responses were divided arbitrarily into study examples (between 0 and 5), with the remaining responses as query examples. Additional variety was produced by shuffling the order of the study examples, as well as randomly remapping the input and output symbols compared to those in the raw data, without altering the structure of the underlying mapping. A major division between ML approaches is between non-symbolic approaches such as neural nets, where the learned knowledge is only implicitly represented, and symbolic approaches, where the knowledge is explicitly represented in a symbolic form. There has been considerable recent research into the use of non-symbolic ML techniques for the learning of model transformations and other translations of software languages, for example [1, 3, 4, 12, 16, 27]. These approaches are usually adapted from non-symbolic ML approaches used in the machine translation of natural languages, such as LSTM neural networks [14] enhanced with various attention mechanisms.
The ideal, obviously, is to choose assumptions that allow a system to learn flexibly and produce accurate decisions about their inputs. Symbols also serve to transfer learning in another sense, not from one human to another, but from one situation to another, over the course of a single individual’s life. That is, a symbol offers a level of abstraction above the concrete and granular details of our sensory experience, an abstraction that allows us to transfer what we’ve learned in one place to a problem we may encounter somewhere else. In a certain sense, every abstract category, like chair, asserts an analogy between all the disparate objects called chairs, and we transfer our knowledge about one chair to another with the help of the symbol. In a nutshell, symbolic AI involves the explicit embedding of human knowledge and behavior rules into computer programs.
These approaches are not suitable for our goal, since the learned translators are not represented explicitly, but only implicitly in the internal parameters of the neural net. Thus, it is difficult to formally verify the translators, or to manually adapt them. In addition, neural-net ML approaches typically require large training datasets (e.g., over 100MB) and long training times. The meaning of each word in the few-shot learning task (Fig. 2) is described as follows (see the ‘Interpretation grammars’ section for formal definitions, and note that the mapping of words to meanings was varied across participants).
In our paper “Robust High-dimensional Memory-augmented Neural Networks” published in Nature Communications,1 we present a new idea linked to neuro-symbolic AI, based on vector-symbolic architectures. The automated theorem provers discussed below can prove theorems in first-order logic. Horn clause logic is more restricted than first-order logic and is used in logic programming languages such as Prolog. first-order logic include temporal logic, to handle time; epistemic logic, to reason about agent knowledge; modal logic, to handle possibility and necessity; and probabilistic logics to handle logic and probability together. The testing was conducted in a laboratory room with four separate workstations, and participants were positioned approximately 50 cm from the screen. In terms of technological requirements, an Antlr parser for the target language is required, in addition to AgileUML. Both Antlr and AgileUML are lightweight tools, with no further technology dependencies except for Java. This is in contrast to tools such as EGL and Acceleo, which require significant technology stacks.
